Let's fix
Method 1
Start game in steam big picture

Method 2
Start the game with using ONLY a mouse / keyboard. I mean, the sound will be bugged when you use a start button on your gamepad. Just use a mouse to start a game and when you see "press any button" - use a mouse. After that you can continue use a controller

Method 3
Remove your controller and plug it in after the game starts (after a "press eny button" screen)

Method 4
Remove your headset or change any paramets in control panel and plug it in later

Method 5
Delete game and download a emulator

AS of 2025 update: With my old videocard the soundbug would happen everytime on my pc, but not if I streamed the game to my phone or my apple tv. Upon upgrading my videocard the soundbug dissapeared entirely.

This worked for me:

Start the game without a controller. Press any button to get to then menu and then plugin/turn on your controller. In my case even when I plugged it in the game wouldn't recognize it. Keep the controller plugged in, quit the game, then restart the game with the controller still on/plugged in and that should fix the sound.
